TL;DR¶
Establishes the first unified theoretical framework to understand the generalization behavior of Transformers on arithmetic tasks (addition/multiplication/modular arithmetic). Starting from the interaction between task properties (translation invariance) and position encoding types (APE/RPE), it explains several previous generalization puzzles that perplexed the field (e.g., addition generalizes but multiplication does not, mod 100 generalizes but mod 101 does not). These theoretical predictions are validated by experiments.
Background & Motivation¶
Background: While Transformers perform exceptionally well on many tasks, their generalization capability—especially length generalization (whether they can handle inputs longer than those seen during training)—remains poorly understood. Arithmetic tasks, due to their controllability, serve as ideal probes for studying generalization.
Limitations of Prior Work: Prior studies discovered a series of counter-intuitive generalization phenomena but lacked a unified explanation—(a) training addition with RPE generalizes to longer digits, but multiplication does not; (b) mod 100 operations perfectly generalize to arbitrarily long inputs, but mod 101 fails; (c) what is the root cause of these differences? Previous works only modified model components (position encodings/attention) without analyzing the properties of the tasks themselves.
Key Challenge: Different arithmetic tasks appear highly similar (all being numerical operations), yet their generalization behaviors are starkly different—the issue lies not in the model, but in the matching between task properties and model assumptions.
Goal: To establish a theoretical framework that explains the differences in generalization behavior of Transformers across various arithmetic tasks from the perspective of task properties.
Key Insight: Focusing on "translation invariance"—the digit-wise calculation of addition remains invariant under digit translation (\(1234+5678\) and \(12340+56780\) share the same digit-wise operations), which naturally aligns with the relative position encoding of RPE. Multiplication does not possess this property, and modular arithmetic depends on whether the modulus aligns with the base (10).
Core Idea: Task translation invariance \(\times\) matching of position encoding = generalization behavior.
Method¶
Overall Architecture¶
The theoretical analysis framework integrates three elements: (1) the universal approximation capability of autoregressive Transformers; (2) task-specific mathematical property analysis (translation invariance, base alignment); and (3) the influence of training data distribution on generalization. It assumes that once the model converges on the training data, its generalization behavior is determined by the task properties.

Translation Invariance Analysis:
- Function: Defines and validates the translation invariance of different arithmetic tasks.
- Mechanism: If both operands are simultaneously translated by \(k\) digits (padding zeros at the high or low positions), does the calculation result maintain the same digit-wise relationship?
- Addition: Translation invariant (digit-wise carry calculation depends only on relative positions) \(\to\) matches with RPE \(\to\) successful generalization.
- Multiplication: Non-translation invariant (cross terms break locality) \(\to\) RPE still fails to generalize.
- Design Motivation: Translation invariance is a concise mathematical criterion that directly determines whether RPE can transfer knowledge from the training domain to longer inputs.

Base Alignment Analysis (Modular Arithmetic):
- Function: Explains the generalization discrepancy between mod 100 and mod 101.
- Mechanism: Mod 100 = \(10^2\), aligned with the decimal base — \(11234 \bmod 100 = 1234 \bmod 100 = 34\), meaning higher-order digits can be directly discarded without affecting the result. However, mod 101 does not divide \(10^n\) — \(11234 \bmod 101 \neq 1234 \bmod 101\), meaning higher-order information cannot be ignored.
- Design Motivation: This explains the mysterious phenomenon in previous literature where "mod 100 generalizes but mod 101 does not."

Upward/Downward OOD Generalization:
- Function: Distinguishes between generalization to shorter and longer domains.
- Mechanism: Given training on \(n\)-digit operations, downward generalization refers to generalizing to fewer than \(n\) digits (e.g., training with \(n=4\) but testing 3-digit addition), and upward generalization refers to more than \(n\) digits. Theoretical analysis shows that downward generalization is relatively easy under both APE and RPE, whereas upward generalization depends on the task properties.
- Design Motivation: Prior literature often failed to distinguish between these two generalization directions, leading to confusing conclusions.

Key Findings¶
- Perfect alignment between theoretical predictions and experiments—theoretical predictions for all 12 combinations (task \(\times\) encoding \(\times\) generalization direction) are fully verified by experiments.
- Translation invariance is key to the successful generalization of addition—RPE preserves this invariance, while APE destroys it.
- Cross terms in multiplication make it naturally non-translation invariant—no position encoding can achieve generalization.
- Generalization in modular arithmetic depends on whether the modulus divides \(10^n\)—this is a pure number-theoretic property.
- Training data distribution is more important than data quantity—a meticulously designed training set can achieve data-efficient generalization.

- The core insight of "the issue lies not in the model but in the task" subverts the prior research paradigm—where previously researchers attempted to modify models to improve generalization, this paper proves that generalization behavior is determined by the mathematical properties of the task. This is an epistemological contribution.

Limitations & Future Work¶
- The theoretical framework is limited to arithmetic tasks—it remains unclear whether it can be extended to more complex mathematical reasoning (e.g., algebra, geometry) or natural language tasks.
- Assumes perfect convergence of the model on the training domain—in practice, the quality of convergence affects generalization.
- Only considers decimal representation—conclusions might differ under other bases or mixed representations.
- Experimental model scales are relatively small (nanoGPT series)—ultra-large models might exhibit different behaviors.
