Scalable and Accurate Graph Reasoning with LLM-Based Multi-Agents¶

TL;DR¶
This paper proposes GraphAgent-Reasoner (GAR), inspired by distributed graph computation theory. It decomposes graph problems into node-centric subtasks assigned to multiple agents, which collaborate through neighbor message passing. GAR extends the graph scale tractable by LLMs from 100 nodes to 1,000 nodes, and significantly outperforms existing state-of-the-art methods on polynomial-time graph reasoning tasks.
Background & Motivation¶
Background: Using LLMs for graph reasoning is an emerging direction; however, existing methods can only handle small-scale graphs (<20 nodes), with accuracy on tasks such as connectivity and shortest path ranging from only 20% to 60%.
Limitations of Prior Work: (a) Describing graph structures in natural language leads to extremely long inputs that exceed LLM context capacity; (b) a single LLM cannot accurately memorize and understand complex graph structures — one-hop neighbor recall accuracy degrades rapidly as node count increases; (c) fine-tuning-based methods (e.g., GraphWiz) suffer from severe overfitting and fail to generalize to new tasks.
Key Challenge: The number of edges can grow quadratically with the number of nodes, yet LLMs have limited capacity to process long texts, and graph reasoning requires precise inference that tolerates no semantic deviation.
Key Insight: Simulate distributed graph computation — assign one agent per node, each processing only its local information and neighbor messages.
Core Idea: A master LLM decomposes the graph problem into a distributed algorithm consisting of six components (State / Message / Init / Send / Update / Terminate). Each node agent processes only local state and neighbor messages, collaboratively solving the problem through multi-round message passing.
Method¶
Overall Architecture¶
The input consists of a graph description \(\mathcal{G}\) and a task description \(\mathcal{Q}\); the output is the graph reasoning answer. The pipeline proceeds in four steps: 1. Graph Construction: The master extracts node and edge information and creates one agent per node. 2. Algorithm Establishing: The master retrieves relevant algorithm templates from a distributed algorithm library and adapts them to generate the six components. 3. Distributed Execution: Agents execute multi-round cycles of "receive messages → update state → send messages" according to the algorithm. 4. Master Summarization: The master aggregates the final states of all agents and derives the answer.

Distributed Algorithm Paradigm:

Key Findings¶
- Substantial improvement over existing methods: Average accuracy on polynomial-time tasks reaches ~86%, far exceeding direct inference with GPT-4o (~40%) and the fine-tuned model GraphWiz (~50%).
- Scalable to 1,000 nodes: Other methods fail or collapse in accuracy at 200+ nodes, whereas GAR maintains 75–85% accuracy.
- GraphWiz exhibits severe overfitting: It completely fails on rephrased real-world graph problems, demonstrating that fine-tuning learns surface patterns rather than graph algorithms.
- Real-world applicability: GAR demonstrates practical potential on web importance analysis (a PageRank variant).
Highlights & Insights¶
- Transferring the ideas of distributed graph computation to LLM agents is an elegant design — "if a single LLM cannot handle large graphs, decompose and conquer with multiple LLMs." This not only addresses the scalability problem but also makes the reasoning process transparent and traceable.
- The unified six-component distributed paradigm is a clever way to encode graph algorithm knowledge in an LLM-interpretable format — one that can be generalized to other agent scenarios requiring distributed processing.
Limitations & Future Work¶
- The number of agents equals the number of nodes; graphs with 1,000+ nodes require 1,000+ agents running in parallel, incurring substantial computational cost.
- The approach is effective only for polynomial-time tasks; its performance on NP-hard problems (e.g., graph coloring, TSP) remains unexplored.
- Each agent constitutes a full LLM call, and multi-round message passing leads to enormous token consumption.
- The master must correctly identify the problem type and retrieve an appropriate algorithm template, which may fail for novel graph problems.
- Message passing between agents may introduce hallucination propagation — errors from a single agent can spread through the network to other nodes.
- The algorithm library has limited coverage and may not apply to graph algorithms absent from the library (e.g., graph neural network-style tasks).
- The synchronization overhead of multi-round communication is not quantified — every round requires all agents to complete before proceeding, meaning straggler agents slow overall progress.
Related Work & Insights¶
- vs. GraphWiz: GraphWiz fine-tunes LLMs for graph reasoning but suffers from severe overfitting and fails on rephrased problems. GAR requires no fine-tuning and leverages LLMs' pre-trained knowledge through the distributed paradigm.
- vs. Single-LLM Graph Reasoning: Single LLMs begin to collapse at 50+ nodes; GAR resolves the scalability issue by distributing information.
