TL;DR

This work systematically compares language model architectures via controlled synthetic pretraining tasks, and finds that the Canon layerโ€”a lightweight component performing weighted summation over neighboring tokensโ€”significantly enhances core capabilities including reasoning depth (2โ€“4ร—), reasoning breadth, and knowledge capacity, enabling NoPE to match RoPE and GLA to rival Mamba2/GDN.

Background & Motivation

Understanding architectural differences in language models is highly challenging, particularly at academic-scale pretraining (e.g., 1.3B parameters, 100B tokens), where results tend to be dominated by noise and randomness. The authors identify three core challenges:

Unreliable pretraining loss: Perplexity does not reliably reflect actual capabilities; models such as Mamba exhibit low early PPL yet weak reasoning.

Noise below emergence thresholds: At academic scale, models often fail even the simplest 2-hop reasoning, and random fluctuations of 2โ€“4% obscure architectural differences.

Data quality and curriculum learning: Reasoning samples are scarce in training data, and grokking behavior renders training highly stochastic.

Core approach: design controlled synthetic pretraining tasks that decompose intelligence into atomic components (reasoning depth, breadth, knowledge capacity, etc.) and compare architectures under clean, controllable conditions.

Method

Overall Architecture

Five synthetic pretraining tasks: - Depo (reasoning depth): directed \(k\)-hop traversal over ordered permutations - Brevo (reasoning breadth): recursive subgraph topological sorting over DAGs - Capo (knowledge capacity): bit-per-parameter storage of synthetic biographies - Mano (knowledge manipulation): multi-step mental arithmetic over modular operations - Lano (hierarchical language structure): structural reasoning over CFGs

Key Designs

Definition of the Canon layer: $\(h_t' = w_0 \odot h_t + w_1 \odot h_{t-1} + w_2 \odot h_{t-2} + w_3 \odot h_{t-3}\)$

The Canon layer is a lightweight "horizontal residual connection" that performs local information mixing across adjacent tokens. Its name is inspired by the musical canon, where a melody is overlaid with itself at fixed time delays.

Four insertion positions: - Canon-A: before the attention block (after RMSNorm) - Canon-B: inside the attention block (after Q/K/V projection) - Canon-C: before the MLP block (after RMSNorm) - Canon-D: inside the MLP (before the activation function)

Canon-ABCD (full version) flexibly adapts to all sequential architectures including Transformers, linear attention, and SSMs.

Implementation: uses causal_conv1d (kernel size 4) with a residual connection, requiring only a few lines of code modification, with a parameter overhead of <0.5%.

Loss & Training

  • All architectures use identical training settings (batch size, steps, learning rate, etc.)
  • Fixed random seeds ensure consistent training data across runs
  • Each task is evaluated across 3 data scales ร— 4 model sizes (3ร—4 mini scaling laws)
  • Best results reported across 4 learning rates

Key Findings

  1. Canon layers are remarkably effective: a <0.5% parameter overhead yields a 2โ€“4ร— improvement in reasoning depth.
  2. NoPE + Canon โ‰ˆ RoPE + Canon: Canon layers eliminate the necessity of positional encodings.
  3. GLA + Canon โ‰ˆ Mamba2/GDN: a simple GLA+Canon combination can rival more complex SSM designs.
  4. conv1d is critical in Mamba2: removing conv1d degrades Mamba2 to the level of GLA.
  5. Depth reasoning bottleneck in linear models: the limiting factor is not insufficient memory but accumulated errors in compression and retrieval.
  6. Academic-scale pretraining is too noisy: in 1.3B/100B experiments, most architectural differences are statistically insignificant.

Highlights & Insights

  1. Physics-inspired methodology: the paper imports the notion of frictionless planes and vacuum experiments into LLM research.
  2. Universality of the Canon layer: applicable to all sequential architectures and never degrades performance.
  3. Revealing the essence of Mamba: most of its performance gains stem from conv1d rather than the SSM mechanism itself.
  4. RoPE can be reduced: Canon enables a model with only 1/4 RoPE to surpass full RoPE.
  5. Predictive power of synthetic tasks: trends observed in synthetic experiments are validated in real pretraining.

Limitations & Future Work

  1. Validation is limited to academic scale; results at larger scale (>1.3B/100B) are left for future work.
  2. Canon layers use a fixed kernel size of 4; exploration of dynamic adaptive convolutions is insufficient.
  3. Synthetic tasks are effective but represent only a starting point; additional atomic capability tests can be developed.
  4. In-depth comparison with concurrent work such as MTA is absent.
  5. The optimal mixing ratio for Transformerโ€“linear model hybrid architectures remains to be studied.
  • H3/Mamba: shift-SSM (the precursor to Canon-B)
  • Primer: Multi-DConv-Head Attention (Canon-B without residual)
  • Conformer/CvT: heavy convolutional modules; Canon is considerably more lightweight
  • Knowledge capacity series (Parts 3.1โ€“3.3): preceding work by Allen-Zhu & Li
  • Insight: even a randomly weighted Canon layer yields substantial gains, suggesting that the core requirement is information flow rather than complex computation.
