Background & Motivation

Single-image novel view synthesis (NVS) is a core task in 3D vision. Existing methods fall into two main categories:

  1. 3D-based methods (e.g., Zero123, Zero123++): Train diffusion models on large-scale 3D datasets (such as Objaverse, with 800k objects) to support precise camera angle control, but they are object-centric and generalize poorly to complex scenes containing multiple objects and backgrounds.
  2. 3D-free methods (e.g., HawkI, DreamBooth): Leverage the implicit 3D knowledge within pretrained Stable Diffusion to generate text-controlled view changes without 3D data. They generalize well to complex scenes but lack precise camera angle control.

Key Insight: The CLIP model (the vision-language backbone of Stable Diffusion) understands coarse-grained directions such as "above/side" but cannot comprehend precise angular information like "elevation 30°"—which is the root cause of the lack of camera control in 3D-free methods.

Core Problem

How to achieve single-image novel view synthesis with precise camera control by combining the scene generalization of 3D-free methods with the camera control capability of 3D-based methods, without using 3D datasets and extra training?

Method

Overall Architecture

A four-step test-time optimization pipeline: uses pretrained Zero123++ to generate a weak guidance map, injects 3D angular information into the CLIP embedding space of Stable Diffusion, and achieves precise camera control via LoRA fine-tuning and regularization loss.

Key Designs

  1. Weak Guidance Map Generation: Uses pretrained Zero123++ to generate a prediction map \(I_{view}\) of the target angle \((\alpha_{elev}, \alpha_{azi})\) from the input image \(I_{input}\). Although this prediction is of raw quality (especially in complex scenes), it provides directional guidance.

  2. Four-step Test-time Optimization:

    • Step 1: Optimizes the CLIP text embedding \(e_{optim}\) to reconstruct \(I_{input}\) most accurately (1000 iterations, lr=1e-3).
    • Step 2: Fine-tunes the LoRA layers of the UNet at \(e_{optim}\) to reconstruct \(I_{input}\) (500 iterations, lr=2e-4).
    • Step 3: Further optimizes the embedding to \(e_{view}\) to reconstruct the weak guidance map \(I_{view}\) (500 iterations).
    • Step 4: Fine-tunes the LoRA layers to reconstruct \(I_{view}\) while incorporating a view regularization loss (250 iterations).
  3. View Regularization Loss (Core Contribution): $\(L_{reg} = \|e_{view} - e_{target}\|^2\)$ where \(e_{target}\) is the text embedding containing target elevation/azimuth information (e.g., "View from +30 degrees evaluation"). This regularization injects 3D angular knowledge into the CLIP space, compensating for CLIP's lack of understanding of precise angles.

  4. Mutual Information Guided Inference: The generation stage uses target text descriptions (angle + scene description) and applies mutual information guidance to ensure consistency between the generated content and the input image.

Loss & Training

  • Maximum LPIPS improvement of 0.1712 (compared to HawkI-Syn (-20°,210°)), which is 5.2 times the maximum gap reported in the Zero123++ paper.

Ablation Study

  • Removing view regularization loss → Camera angle control degrades, rendering generated views inconsistent.

  • Dependency on SD 2.1 + Zero123++: If Zero123++ fails completely in certain scenarios, the low quality of the weak guidance map may degrade the final results.
  • Limited evaluation scenarios: Only evaluated on two small datasets (HawkI-Syn and HawkI-Real), and not compared on standard 3D benchmarks (e.g., GSO, Objaverse-LVIS).
  • Limited range of angles: Only evaluated on 4 fixed combinations of angles; the effects of extreme angle changes (e.g., 180° rotation) have not been validated.
  • Resolution limit: Generates at 512×512 resolution; high-resolution generation has not been explored.
  • vs Zero123++ (3D-based): Zero123++ loses backgrounds and details in complex scenes, whereas this method preserves the full scene via 3D-free optimization; however, Zero123++ has much faster inference speed.
